Navigating Shadow AI and Technical Debt

Exploring the 2024 State of AI Security Report

As highlighted in the 2024 State of AI Security Report, shadow AI—the unmonitored, unapproved adoption of AI technologies across business units—presents a growing challenge. Much like the early days of cloud computing, departments within organizations are adopting AI solutions independently, driven by immediate business needs rather than long-term strategic thinking. According to the report, the number of organizations that have adopted AI to build applications is as high as 56%. While it may offer organizations increased productivity, these models are being deployed without proper oversight, creating blind spots for security teams and resulting in a proliferation of misconfigured AI assets, many of which may carry vulnerabilities.

At the same time, unchecked AI adoption can accumulate significant technical debt. In the rush to innovate, departments often overlook the downstream impact of AI implementations, compounded by complex models, hidden dependencies, and feedback loops that make systems increasingly challenging to manage.

This said CIOs are at a critical juncture. The speed of AI deployment is enticing, but history has taught us that it can lead to severe technical debt without proper governance. The temptation to bypass IT’s oversight in favor of speed creates an environment ripe for security breaches, operational disruptions, and accumulated debt—all of which threaten the organization's stability.

Containment While Accelerating Innovation

This might all sound scary, but this is not a reason to turn our backs on AI adoption. John Rauser of Cisco recently said at the Enterprise Technology Leadership Summit that even a 1% productivity gain at a large enterprise can amount to millions or billions of dollars in value. The key is to use these tools with the proper guidelines to maximize the productivity AI tools can create. Organizations need to improve at containing risks while enabling the business to move faster. The 2024 State of AI Security Report outlines significant security misconfigurations: 98% of Amazon SageMaker notebooks still have root access enabled, and 62% of organizations use AI packages with at least one known vulnerability. These vulnerabilities may seem minor now, but they foreshadow more significant crises as AI becomes more deeply embedded in enterprise operations.

The future of AI governance will depend on cross-functional collaboration between AI, security, and IT operations. Shadow AI must be managed, and this begins with creating a centralized AI governance framework—where all AI systems, from chatbots to complex models, go through a standardized vetting process. Without this, the accumulation of configuration debt, correction cascades, and glue code and infrastructure will eventually paralyze IT systems.

Technical Debt: The Silent Killer

Technical debt in AI systems goes beyond the code—it seeps into the architecture, data dependencies, and even organizational processes. For instance, hidden feedback loops in AI systems can create unexpected behaviors or reinforce errors, making managing and maintaining long-term increasingly tricky. This is where site reliability engineering (SRE) teams play a critical role, working alongside AI experts to ensure that systems are scalable and resilient.

Addressing this requires an ongoing effort to refactor and simplify AI architectures. The allure of autonomous AI is speed, but unless we actively manage technical debt, we’ll find ourselves in a reactive mode, fighting fires caused by system failures, security breaches, and unforeseen dependencies.

However, one of the mistakes organizations are making is telling their new AI teams not to get slowed down by their traditional IT departments (e.g., DevOps, DevSecOps, and SRE).

Security First, Always

We must recognize the security implications of this new AI era. The more we rely on AI, the more vulnerabilities we introduce into our systems. Adversarial attacks on AI models, such as data and model poisoning or model theft, are becoming more sophisticated, and unmonitored shadow AI only increases the attack surface. Similarly, the State of AI Security Report echoes this sentiment, emphasizing the importance of proactively securing AI services by disabling default access settings, encrypting data at rest, and managing API keys properly.

To succeed, CIOs must balance the drive for innovation with the need for robust, sustainable infrastructure. The lessons of shadow AI and technical debt teach us that containment—of risks, vulnerabilities, and debt—must go hand-in-hand with innovation. By embracing a culture of cross-functional collaboration, AI governance, and continuous debt management, we can ensure that our organizations thrive in this new era of AI without being crippled by the very technology that promises so much.

There is no turning back from AI, but with the right containment strategies, we can confidently move forward—faster, smarter, and more secure.
